You built an AI assistant. You gave it a system message, connected it to your tools, maybe even wrote a fancy prompt.

And it doesn’t work.

It hallucinates. It forgets context. It does things you did not ask for. It sounds confident while being completely wrong.

So you switch the model. You rewrite the prompt. You add more tools. And it still doesn’t work.

Here is what is actually going wrong — and it has nothing to do with the AI.


The Problem Is Not the Model

The model is the last link in a chain. Before it generates a response, a lot of things have to go right:

  1. The system message — does it actually describe what the assistant should do?
  2. The context — does the model have the information it needs?
  3. The tools — are they connected correctly? Do they return useful data?
  4. The prompt — is the user’s request clear enough for the model to act on?
  5. The memory — does the assistant remember what happened before?

If any of these are broken, the model will fail. And it will fail confidently, because that is what language models do — they generate plausible text. They do not know when they are wrong.

The model is not the problem. The problem is everything around it.


The System Message Is Not a Mission Statement

Most system messages I see look like this:

“You are a helpful AI assistant. You are polite, professional, and always try to help the user.”

This tells the model nothing. “Helpful” is not a behavior. “Polite” is not a constraint. This is a mission statement, not an instruction.

A useful system message answers three questions:

What should the assistant do? Not “help the user.” Be specific. “You draft blog posts in Ruslan’s writing style. You follow the style guide in writing-style.md. You never publish without approval.”

What should the assistant NOT do? This is more important than the first question. “You do not make commits without asking. You do not change the blog’s structure. You do not add features that were not requested.”

What does the assistant know about the user? Context about who it is talking to, what they care about, what projects they are working on. Without this, the model defaults to generic.

The difference is not length. The difference is specificity.


Context Is Not What You Think It Is

When people say “the model doesn’t have context,” they usually mean the conversation history. But context is bigger than that.

Context is everything the model needs to do its job:

  • Who is the user? What do they care about? What projects are they working on?
  • What is the current state? What was already decided? What was already tried?
  • What are the constraints? What should not be changed? What is off-limits?
  • What does success look like? What does the user actually want as output?

If you do not provide this, the model will guess. And the model’s guess is based on the average of everything it has seen in training data — which is not your situation.

Same request. Completely different output.


Tools Are Not Magic

You connected the model to your database, your API, your file system. Great.

But the model does not know how to use these tools unless you tell it.

Every tool needs:

  • A clear description of what it does
  • Clear parameters — what it expects as input
  • Clear output — what it returns
  • Error handling — what the model should do when the tool fails

If the tool description is vague, the model will call it at the wrong time, with the wrong parameters, and then hallucinate the result when it fails.

The model is only as good as the instructions you give it. Including tool instructions.


The Prompt Is Not the Problem (Until It Is)

Most of the time, the prompt is fine. The user asked a reasonable question. The model had the context. The tools were connected.

And the output is still wrong.

This is usually a system message or context problem, not a prompt problem. The model did exactly what it was told — it was just told the wrong thing.

But sometimes the prompt is the problem. Vague requests get vague responses.

"Review the draft in content/guides/llm-parameters.md. Check for AI clichés
(like 'X is not Y, it is Z' patterns). Flag any sentences that sound like
marketing copy. Do not rewrite — just list the issues."

The model cannot read your mind. The more specific the request, the better the output.


Memory Is a Feature You Have to Build

Most AI assistants do not remember anything between conversations. Each session starts fresh.

This is not a bug. It is how LLMs work — they have no persistent memory by default.

If you want the assistant to remember things, you have to build that:

  • Write important context to a file (like MEMORY.md) and load it each session
  • Summarize decisions and store them somewhere the model can read
  • Track state — what was done, what is in progress, what is blocked

Without this, you will explain the same thing every session. The model will make the same mistakes. You will think the model is stupid. It is not stupid. It just does not remember.


The Real Checklist

Before you blame the model, check these:

□ System message — specific about what to do and what NOT to do
□ Context — does the model know who the user is and what they need?
□ Tools — are they clearly described with input/output expectations?
□ Prompt — is the request specific enough?
□ Memory — does the assistant persist important context between sessions?
□ Testing — did you test with real inputs, not just the happy path?

If any of these are missing, fix that first. Then test again.

The model is probably fine. The setup is what needs work.


The Uncomfortable Truth

Building a working AI assistant is not about finding the right model or writing the perfect prompt.

It is about understanding your own process well enough to explain it to a machine.

And that is the part most people skip. They want the AI to just know. To read their mind. To figure it out.

The AI will figure something out. It just might not be what you wanted.

The better you describe what you need, the better the output. This is not a limitation of the technology. It is the whole game.
